Computer shuts off, possible PSU problem

So I've been having my problem for a while, and I haven't been able to figure it out.
First of all my computer is my first custom built, but I made sure to follow guides / tutorials, and of course followed instructions for the individual parts while building it.

My problem first happened when I was just surfing the web, my computer just completely shut off without warning. When I tried to turn it on, the fans would spin up once, lights flashed once and it just turned off again. I had no way of fixing it and the problem somehow, "fixed" itself after a week or so of being left unplugged, and it turned on as usual.
But then the exact same thing happened a second time while I was watching a movie on my computer, random shut off, fans spin once, lights flashed, and I had to wait for it to again fix itself.

This happened 3 or 4 more times, one of those times when I just left the computer on standby.
I then attempted to fix it by completely unplugging everything, taking it out of the case, to check all the standoffs and fix anything that I would see not working properly. After doing this, my computer did turn on which seemed like it would be a temporary fix, because now(a couple of weeks later), the problem has happened yet again.
I tried to replug everything again(motherboard, graphics card, etc.) But this time I didn't take it out of the case, it still doesn't work.

I've also noticed something very odd while trying to fix it, when I just plug my cpu in to the power outlet, my speakers(water speakers with a lot of lights) would already turn on with all the lights even if I don't press the power button. So I know there is power going through the computer, but the computer still just spins up, lights flash once and nothing.
But, then I noticed even when I UNPLUG the power cord, the water speakers, STILL stay on for about several seconds before actually turning off, during these several or so seconds, I'm also able to try and turn on my computer to which it spins up once, and yeah same as always.

Because of the odd problem of power being in the computer that long even with no cord attached, I'm beginning to think it's a psu related problem.

On a side note, my psu has an anti short circuit built in, but I have no idea if that is what is preventing my computer turning on or not.
Thanks for help in advance, I've had this problem for so long and I'd be so happy to fix it once and for all.

What is the model and brand of the PSU. Give us the exact model number off the label.
