PC turn on 1 sec then off, cpu fan not spinning

Ok, so my PC suddenly turn off randomly yesterday and after a while it just won't turn on anymore. I'd turn on the PC and it powers on for a sec, PSU fan spin, GPU fan spin, LED lights on, but CPU fan not spinning. Tried removing the RAMs, and also connection to all of the fans, but still, CPU fan not spinning. (Updated info in this post)

Is it because of my PSU? or is it my CPU that causes this?

Some history about my PC :
Recently the big side fan died and I noticed a rise in the temp to almost 60 for normal use and 97 for heavy use. I changed the side fan to NZXT FZ200 about a month later (use desk fan to help cooling with case side panel open during those time), but since my GPU has this side pipes, the new fan ends up really close to the GPU (about 1cm gap). After that I noticed that my system is throwing error: "Display driver's not responding but has successfully recovered" whenever I play games. Thought it was because of the fan, I decided to remove the case's sidepanel and place it near the case because i left the new fan connected so it can help pushing air into the case. The error no longer appear and I thought it's ok, when suddenly if I open up my game, my PC died after a few minutes into the game. If I don't play any games, it'll die after a few hours. I monitored the temps with CoreTemp and under normal use it never go beyond 45, and when I start the game the temp spike to 50-60 for a few sec then stays around 50 (i don't know what the temp is when I'm in the game). This is the last thing happened before my PC won't turn on.

GPU: HIS Radeon 7850 IceQ
Mobo: Gigabyte DS3H-h77
CPU: Intel i5-3570
PSU: Corsair CX600
RAM: ValueSelect 4Gb 2x
CHASSIS: Armaggeddon Triton T3
All fans are original chassis fan except side fan (died and changed to NZXT FZ200RB)

I believe this a cooling and power supply problem.

My suggestion is to purchase an aftermarket cooler and a new power supply with better quality components.

Thanks for the suggestion, I thought Corsair's PSUs are alright... I still have a warranty on it, so if it's possible I probably would try to RMA it. Anywyas, I can't find XFX in my country, is there another PSU brand that just as good? (There're only distributors for Thermaltake, Corsair, Silverstone, Rosewill, and Enermax here.)

Ok, some update. I took out the GPU, and my PC turns on (at least there's a POST beep sound). Although, for first few second it seems to struggle, my PSU turns on, and my CPU fan seems like trying to spin but stop for a few second then die, and the system shut down on its own. Right after that it turns on (on its own) and for a few sec my CPU fan struggled again, but it continued to the POST beep and a second after that, the fan is spinning just fine. (i tried this with only HDD, PSU, and CPU connected to mobo)

I can't see what the display is since i didn't plug in the monitor...

So, with this new information, is it more like PSU problem? Maybe it can't generate enough for GPU if it's installed? Or is my GPU faulty?

Yeah, tested it without all of the fans (including new one) and RAM, but if the GPU is installed, the CPU fan just won't spin. If i take off the GPU, the CPU fan will spin.

Anyways, if it's really the PSU, is it because my PC often randomly die or perhaps the overheat from losing the side fan plays a factor too?
