I have an old machine, around 11 years old. I revived it by installing more RAM and using Linux distros and it somehow serves as a backup machine for day to day activities. However, due to a screwed up monitor I didn't switch it on for a few months. Today, I purchased a new monitor and tried booting up the machine. However, when I press the power button it switches on, the fans turn on, and then within a few moments it switches off. And the same thing repeats until I turn off the main power supply. I tried removing the CMOS battery and putting it back again. I even checked all the RAMs individually. But it doesn't work. Any sort of help will be appreciated.

It could be almost anything. 11 years old? Could be failed hard drive, motherboard, power supply ect. Impossible to say. If you actually want to get it diagnosed professionally but not fixed it will usually run you 30-50 bucks.

The HDD seems to run, as in it gets heated up. I had changed the PSU around 7 months back. Is there anything that I might be missing?

Just because it heats up doesn't mean anything. A PSU can be defective too even if it can power your computer. I literally just had both a PSU and HDD fail on me and both could power on. I could even install windows on the shoddy HDD and power supply before it failed again after an hour. Also some new PSUs can fail very quickly apparently.
