VGA problem and strange start up/shut down

Every time I have turned the PC on since I first tried booting it, it has done this strange start up where this high pitch noise revs up and then all the lights turn off and come back on. Then, when shutting down, the lights make a big flash and everything turns off.

I tried booting my PC without the graphics card in, just with my HDMI in my motherboard, and I was able to reach BIOS, install windows, and use windows.

When I installed the graphics card and plugged the HDMI it, I never got anything on my monitor. And the red VGA led is lit up on my motherboard. I then have to hold the power button to get it to turn off.

When trying the graphics card, I also noticed that when I turned the switch on the back of the PSU, my keyboard would flash, even though my PC wasn't on. Then, when turning the system off, I would hold the power button on the case and everything would turn off, but the motherboard would still light up.

This is my first experience with building a PC and I am totally lost. Anything helps. Thank you.

(I have tried a different PCIE slot and a different VGA cable)

Have you made sure your motherboard BIOS is up to date? Without the fans, HDD and one stick of ram, see if the issue persists both inside and out of the case.
